在临床上,使用低剂量X-Ray进行计算断层扫描(LDCT)是比较理想的,因为它可以减少病人的辐射剂量。然而,由于不可避免的强量子噪声,LDCT图像的质量往往不理想。基于深度学习(DL)的LDCT去燥技术已经在计算机视觉领域得到了广泛的应用。然而,尽管DL模型有很好的去噪能力,但研究人员发现去噪后的图像分辨率较低,降低了其临床应用价值。来自德克萨斯大学西南医学中心放射肿瘤学系医学人工智能与自动化实验室的研究学者们在期刊Journal of Artificial Intelligence of Medical Sciences(eISSN 2666-1470)上发表了题为“Deep High-Resolution Network for Low-Dose X-Ray CT Denoising”的文章,通过引入高分辨率网络(HRNet)开发了一种更有效的去噪器。

要点介绍

X射线计算机断层扫描(CT)在临床上被广泛应用于对患者的内脏器官进行成像以便医生进行诊断。然而,X射线CT扫描所涉及的辐射剂量对人体构成了潜在的健康问题,因为它可能诱发遗传、癌症和其他疾病。因此,在确定CT扫描的辐射剂量水平时,遵循尽可能低的合理可行(ALARA)原则在临床上是最重要的。降低剂量水平的主要方法之一是降低每个投影角的曝光水平。然而,较低的曝光量不可避免地会在CT图像中引入较强的量子噪声,从而降低了这些图像的临床价值。因此,去噪算法对于提高低剂量CTLDCT)图像的质量至关重要。在这方面的研究已经有了很大的发展,大致可以分为三类:基于投影域的去噪,基于图像域的去噪以及正则化迭代重建。在这项研究中,我们致力于最后一类,因为我们寻求提高图像质量的LDCT

我们的LDCT图像去噪任务的目标是在尽可能保持分辨率的同时有效地抑制噪声,因为噪声和分辨率是评价CT图像质量的两个重要指标。因此,在设计用于LDCT图像去噪的CNN结构时,提取高质量的低层和高层特征并进行有效的融合是非常重要的。而通过采用更先进的网络结构,可以更有效地提取和融合低层和高层特征,提高去噪CT图像的图像质量。我们引入高分辨率网络(HRNet)开发了一种更有效的去噪器。HRNet由多个子网分支组成,这些子网提取多尺度特征,然后融合在一起,大大提高了生成特征的质量,提高了去噪性能。

1. HRNet架构。四个不同的分支从不同的尺度上提取特征。在前向传播过程中,不同尺度的特征逐渐融合在一起。为了启用由虚线连接指示的融合过程,根据特征的相对大小,首先对先前的特征进行下采样或上采样,使得基于求和的特征融合是有效的。最后,如果需要,将来自不同尺度的所有特征向上采样到原始尺度,并连接在一起,得到最终的特征。最后一层是预测器,输出去噪后的图像。所有卷积层由三个算子组成:卷积、实例归一化和校正非线性单元。最后的预测器由两个算子组成:卷积和校正非线性单元。

研究结论:任何CT去噪器的目标都是在尽可能保留解剖细节的同时尽可能地抑制噪声。基于DL的去噪器通过自动提取图像特征来抑制噪声,从而达到最先进的去噪性能。然而,特征质量在很大程度上取决于模型体系结构。对于去噪任务,低层和高层特征都很重要。前者对于细节的保持非常重要,而后者对于大规模利用上下文信息有效抑制噪声非常重要。编码器-解码器结构对于高级特征提取是有效的,但是它缺乏低级信息。U-Net通过跳转连接可以在一定程度上改善低层特征质量,但仍然不能提供高、低层的特征质量来忠实地恢复细节。

实验结果表明HRNet能够有效地去除噪声,同时很好地保留了人体的精细解剖结构。在某些情况下,HRNet的结果甚至比NDCT更好。这可能是因为我们不仅去除了添加的模拟噪声,而且还去除了从目标NDCT图像中继承的噪声。

总之,在这项工作中,我们引入了一个基于HRNet的去噪器来提高LDCT图像的质量。由于HRNet能同时提取高质量的低层和高层特征,因此它能有效地抑制噪声和保持细节。与基于U-Net的去噪器相比,HRNet可以产生更高分辨率的图像。定量实验表明,基于HRNet的去噪器能将RMSE/SSIM值从113.80/0.550LDCT)改善到55.24/0.745,其性能优于基于U-Net的去噪器(59.87/0.712)。
